There are just too many AI Frameworks

We’ve all been here before. A new technology emerges, frameworks proliferate to make it accessible, and eventually, we hit the ceiling of complexity and fragmentation. The AI ecosystem today feels eerily similar to the early days of JavaScript frameworks or the explosion of NoSQL databases — too many choices, too little consolidation, and a growing sense that we might be making things harder, not easier.
The Current State of AI Framework Proliferation
Walk into any AI conference, scroll through GitHub’s trending repositories, or browse through the latest tech newsletters, and you’ll be bombarded with a dizzying array of AI frameworks, each promising to be the solution to your machine learning problems.
We have:
- Training frameworks: TensorFlow, PyTorch, JAX, MXNet, PaddlePaddle
- Inference frameworks: ONNX Runtime, TensorRT, OpenVINO, TensorFlow Lite
- MLOps frameworks: MLflow, Kubeflow, Metaflow, DVC, Weights & Biases
- AutoML frameworks: AutoKeras, H2O.ai, AutoML-Zero, NNI
- Specialized frameworks: Hugging Face Transformers, spaCy, OpenCV, scikit-learn
- End-to-end platforms: SageMaker, Vertex AI, Azure ML, Databricks
And this is just scratching the surface. Each week brings new frameworks, new abstractions, and new promises of simplification.
The Problem with Choice Overload

When faced with dozens of viable options, developers spend more time evaluating frameworks than actually building solutions. The cognitive load of understanding the trade-offs between frameworks can be overwhelming, especially for teams new to AI.
Ecosystem Fragmentation
Unlike mature ecosystems where standards have emerged, the AI space remains highly fragmented. A model trained in one framework might not easily transfer to another. Libraries and tools often lock you into specific ecosystems, making it difficult to adopt best-of-breed solutions.

Every major tech company wants their own AI framework. Google has TensorFlow, Facebook has PyTorch, Microsoft has ONNX, Amazon has SageMaker. Competition drives innovation but also fragmentation.
Academic Research Culture
Academic institutions produce new frameworks as part of research output. While this drives innovation, it also means many frameworks are created to demonstrate concepts rather than solve production problems.
Open Source Momentum
The low barrier to entry for creating and distributing frameworks means that every novel approach can quickly become a new framework, regardless of whether the ecosystem needs it.

Technical Debt
Teams often start with one framework and gradually add others to solve specific problems. Over time, this creates a complex web of dependencies that becomes increasingly difficult to maintain and update.
Talent Acquisition Challenges
When job descriptions list requirements for 5-10 different AI frameworks, the talent pool shrinks dramatically. Companies end up hiring specialists in specific frameworks rather than generalists who understand underlying principles.
Vendor Lock-in
Despite being “open source,” many frameworks create subtle forms of vendor lock-in through cloud integrations, proprietary optimizations, or ecosystem dependencies that make switching costly.

Using multiple frameworks in a single system often means loading multiple runtime environments, dealing with data serialization between systems, and accepting performance penalties for abstraction layers.

The NoSQL movement spawned hundreds of database solutions, each optimized for specific use cases. While some specialization remains valuable, the market has largely consolidated around a few major players (MongoDB, Cassandra, Redis) for most use cases.

Kubernetes emerged as the winner from a field that included Docker Swarm, Mesos, Nomad, and others. The consolidation brought stability and standardization to the ecosystem.
What the AI Ecosystem Needs
Standardization
We need more emphasis on interoperability standards like ONNX, which allows models to move between frameworks. Standards reduce the risk of framework lock-in and make it easier to adopt best-of-breed tools.
Consolidation Through Acquisition
Many smaller, specialized frameworks should be absorbed into larger ecosystems rather than maintaining independent existence. This would reduce fragmentation while preserving innovation.
Clear Use Case Differentiation
Instead of general-purpose frameworks competing on all dimensions, we need clear differentiation based on use cases: research vs. production, cloud vs. edge, specific domains like NLP or computer vision.
Better Abstraction Layers
High-level APIs that can work across multiple underlying frameworks would reduce the learning curve and switching costs. Projects like Keras (for TensorFlow/Theano) show how abstraction can simplify the ecosystem.

For Individual Developers
- Focus on learning underlying principles rather than framework-specific APIs
- Choose frameworks based on long-term ecosystem health, not just features
- Invest in tools and skills that work across multiple frameworks
- Resist the urge to adopt every new framework that emerges
For Companies
- Standardize on a minimal set of frameworks across the organization
- Invest in internal tooling that abstracts away framework-specific details
- Consider total cost of ownership, including training and maintenance, when choosing frameworks
- Contribute to open standards rather than building proprietary solutions
For the Community
- Support interoperability standards and tools
- Encourage consolidation through collaboration rather than competition
- Focus on solving real problems rather than creating new abstractions
- Document clear migration paths between frameworks

The proliferation of AI frameworks is a natural part of a rapidly evolving field, but we’re reaching a point where the costs outweigh the benefits. Just as other technology ecosystems have matured through consolidation and standardization, the AI ecosystem needs to evolve beyond the current state of fragmentation.
The goal isn’t to stifle innovation or reduce technical diversity, but to create a more sustainable ecosystem where developers can focus on solving problems rather than navigating framework complexity. The future of AI development depends not just on better algorithms and more powerful hardware, but on creating development environments that enable rather than hinder progress. It’s time to acknowledge that sometimes, less choice leads to more innovation.
